What to prune, what to preserve

Data pruning · Elastic models · Post-training blogs · Chinchilla close reading

Two focal papers study pruning training examples and model units; technical blogs add synthetic-data and post-training details. Papers dated October 14–15 are overlap-window additions, not today’s releases. The Chinchilla classic derives optimal allocation conditional on a credible empirical loss surface.

Hard Way, The Only Way: Provable Merits of Training on Hardest Examples

Sorscher et al. (2022) studied pruning-induced changes to learning curves. [3] Here the setting is Gaussian linear classification: dimension NN, sample count PP, perfectly aligned generator/test/pruner directions, and ridgeless squared loss. [1]

Proportional high-dimensional limit, then small phi; A selects margins
ϕ=NP,T=∣G∣, G∼N(0,1),p=Pr⁡(T∈A),μk=E[Tk∣T∈A],ν=Var⁡(T∣T∈A)\phi=\frac NP,\quad T=|G|,\ G\sim\mathcal N(0,1),\quad p=\Pr(T\in A),\quad \mu_k=\mathbb E[T^k\mid T\in A],\quad\nu=\operatorname{Var}(T\mid T\in A)

The paper reduces classification error to an angle; retention must exceed the dimension/sample ratio. [1]

Original equations (32), (36)
Etest≃1πarctan⁡K(A),K(A)=ϕp−ϕμ2νμ12,p>ϕE_{\rm test}\simeq\frac1\pi\arctan\sqrt{K(A)},\qquad K(A)=\frac{\phi}{p-\phi}\frac{\mu_2\nu}{\mu_1^2},\quad p>\phi

A conditional-density bound yields a variance bound; optimization over retention gives the key chain from Appendix E: [1]

The bound minimizes at p=2phi; a thin band asymptotically attains it, retaining about 2N samples
ν≥πp224,μ2μ12≥1 ⟹ K(A)≥πϕp224(p−ϕ)≥πϕ26,p⋆≃2ϕ,E⋆∼ϕ6π\nu\ge\frac{\pi p^2}{24},\quad\frac{\mu_2}{\mu_1^2}\ge1\ \Longrightarrow\ K(A)\ge\frac{\pi\phi p^2}{24(p-\phi)}\ge\frac{\pi\phi^2}{6},\qquad p_\star\simeq2\phi,\quad E_\star\sim\frac{\phi}{\sqrt{6\pi}}

Freeze weights, learn one cross-budget ranking

Fixed-target pruning typically repeats work for each budget. Here only global MLP-neuron/head scores zz are learned; backbone θ\theta stays frozen. Let bb denote removed FLOPs and κb\kappa_b the cost-weighted ranking threshold. [2]

Compact method rewrite; sg stops threshold gradients; hard masks at deployment
Mb(z)=σ ⁣(z−sg⁡(κb(z))τ),min⁡z1∣B∣∑b∈BEDℓ(fθ,Mb(z)(x),y)M_b(z)=\sigma\!\left(\frac{z-\operatorname{sg}(\kappa_b(z))}{\tau}\right),\qquad \min_z\frac1{|\mathcal B|}\sum_{b\in\mathcal B}\mathbb E_{\mathcal D}\ell(f_{\theta,M_b(z)}(x),y)

Fourteen targets (5%–70%), 300 Adam calibration steps; ViT-B uses batch 32 and 2,000 unique images by default. One ranking yields nested subnetworks, not optimization-free adaptation. [2]

Indic: corpus inventory is not training budget

Scaling Indic Pretraining: 2.8 Trillion Tokens and an Open Data Generation Pipeline

Translate, judge, repair, transliterate: 75/100 is a rubric threshold, not accuracy. The 2.8T-token inventory includes shared-source language/script variants and already includes 438.4B recovered tokens. Nemotron CPT uses 10B Indic tokens, natural plus synthetic, so stage gains do not isolate synthetic data. This adds the data side to yesterday’s Nemotron coverage; the corpus is still marked forthcoming. [4]

One epoch of Multilingual-Thinking LoRA SFT changes requested-language adherence from 3/16 to 16/16 held-out prompts: tiny sample, no reasoning-correctness evaluation. Separately, the GRPO recipe uses 32 prompts × 8 responses, group advantages and truncated importance sampling, without KL/entropy penalties. A runnable recipe is not demonstrated downstream improvement. [5]

Experts remain frozen; LoRA targets four attention projections. The reported run uses 64 H100s, 500 steps, length 2,048 and packing, taking about two hours. Training token accuracy rises 72%→84% and loss falls 1.26→0.57; these are training metrics, not held-out capability gains. [6]

Weights were released July 24; this is a new technical write-up. Five stages: SFT → long-context SFT → RL → DPO → SDPO. Reasoning traces are added only where non-thinking fails; tool trajectories require execution verification. Long-context SFT restores ability eroded by short-context SFT; no isolated causal ablation is established here. [7]

Kaplan et al. (2020) favored larger models and less data under fixed compute. [32] Chinchilla re-estimates allocation with over 400 runs: the goal is not convergence, but maximal loss reduction per finite FLOPs budget. [30][31]

Let NN be parameters, DD training tokens and CC training FLOPs. This is an empirical model with positive coefficients, not a neural-network theorem. [30]

Original parametric fit; E is the irreducible term
L^(N,D)=E+AN−α+BD−β,C≃6ND\widehat L(N,D)=E+A N^{-\alpha}+B D^{-\beta},\qquad C\simeq6ND

Substitution of the budget constraint balances marginal gains, not the two loss terms themselves:

Algebra conditional on the empirical model
∂∂log⁡N[AN−α+B(C6N)−β]=0⟺αAN−α=βBD−β\frac{\partial}{\partial\log N}\left[A N^{-\alpha}+B\left(\frac C{6N}\right)^{-\beta}\right]=0\quad\Longleftrightarrow\quad\alpha A N^{-\alpha}=\beta B D^{-\beta}
Original allocation; continuous N,D approximation
G=(αAβB)1/(α+β),N⋆=G(C/6)β/(α+β),D⋆=G−1(C/6)α/(α+β)G=\left(\frac{\alpha A}{\beta B}\right)^{1/(\alpha+\beta)},\qquad N_\star=G(C/6)^{\beta/(\alpha+\beta)},\qquad D_\star=G^{-1}(C/6)^{\alpha/(\alpha+\beta)}
Estimation methodParameter exponent aData exponent b
Training-curve envelope0.500.50
IsoFLOP0.490.51
Parametric loss0.460.54
Original Table 2: N* proportional to C^a and D* to C^b. The three estimates are close, not identical. [30]
Our direct consequence: a constant token/parameter ratio additionally requires alpha=beta
D⋆N⋆=G−2(C/6)(α−β)/(α+β)\frac{D_\star}{N_\star}=G^{-2}(C/6)^{(\alpha-\beta)/(\alpha+\beta)}
